Embedding Models Comparison 2026: OpenAI vs Cohere vs Voyage vs BGE

Q: Can I switch embedding models after my vector index is already populated?

Yes, but it requires a full re-embedding of your corpus. Embedding models produce vectors in different coordinate spaces — a vector from text-embedding-3-large and a vector from voyage-large-2-instruct are not comparable even for identical input text. Mixing vectors from two different models in the same index produces effectively random retrieval results. The migration path is: embed all documents with the new model → build a new index → validate retrieval quality → swap the production index atomically → update query embedding to use the new model. For large corpora, this is a significant operation that needs to be planned, not done reactively.

Q: Does embedding dimensionality directly affect retrieval quality?

Not linearly. Higher dimensionality provides more representational capacity, which can capture finer semantic distinctions — but this only translates to better retrieval if the model is trained to use those dimensions effectively. OpenAI's MRL approach means text-embedding-3-large at 256 dimensions outperforms ada-002 at its full 1,536 dimensions. Choose a model based on MTEB scores and domain fit first, then consider dimensionality's cost implications for storage and ANN search. Do not choose a higher-dimensional model assuming it will outperform a lower-dimensional one.

Q: What is the difference between bi-encoders and cross-encoders, and when should I use a reranker?

Bi-encoders (all models in this comparison) produce independent vector representations for queries and documents; similarity is computed as dot product or cosine similarity. This is efficient at retrieval scale. Cross-encoders (rerankers) score a query-document pair jointly using full attention over both sequences, producing higher-quality relevance scores but at much higher compute cost. The standard production pattern is bi-encoder retrieval (top 50–100 candidates) followed by cross-encoder reranking (re-score to top 5–10). This two-stage pattern consistently outperforms bi-encoder-only retrieval. Use a reranker whenever retrieval quality is a priority and you can tolerate the additional latency.

Q: How important is chunking strategy versus model choice for retrieval quality?

Both matter, and they interact. A superior embedding model cannot fully compensate for poor chunking — if semantically coherent passages are split across chunk boundaries, retrieval will fail even with the best embeddings. Choose a model with a context window that accommodates your typical document structure without forcing fragmentation, then tune chunk size and overlap to minimise boundary semantics loss. For most enterprise document RAG applications, 512-token chunks with 64-token overlap is a reasonable starting point. Sentence-level chunking often outperforms fixed-size chunking for prose documents, at the cost of more chunks and higher index volume.

Q: When does it make sense to fine-tune an embedding model rather than use an off-the-shelf option?

Fine-tuning is warranted when your domain vocabulary is highly specialised and significantly diverges from general web text — clinical notes, technical legal language, proprietary product catalogues. The evidence threshold: your offline evaluation shows the best general-purpose model achieves retrieval accuracy below your quality threshold on a representative query set, and the gap cannot be closed by adjusting chunking or retrieval strategy. Fine-tuning requires labelled training data (query-positive-negative triplets), compute for training, and ongoing evaluation infrastructure. For most enterprise use cases, a well-configured general-purpose model with a tuned reranker will match fine-tuned performance without the maintenance burden.

Q: Is voyage-large-2-instruct worth the cost premium over OpenAI text-embedding-3-large?

At comparable pricing ($0.12 vs $0.13 per 1M tokens), the question becomes whether the MTEB retrieval performance gap justifies any switching cost. For new systems, voyage-large-2-instruct's consistently higher retrieval scores and 16,000-token context window make it the stronger choice on pure technical merit. The consideration against it is vendor maturity — Voyage AI is a smaller organisation, and teams building long-lived production systems should factor in continuity and SLA risk. For code-specific applications, voyage-code-2 has no serious competition. For general enterprise RAG, the performance advantage of Voyage is real but the OpenAI integration convenience may tip the balance for teams already in that ecosystem.
