Q: What is an adversarial evasion attack on a detection model?

An evasion attack modifies a malicious input, such as a malware file, a fraudulent transaction pattern, a bot request or a spam message, so that a trained classifier labels it benign while the malicious function is preserved. NIST AI 100-2 E2025 defines evasion as a test-time attack on a deployed model, distinct from poisoning, which corrupts training data. In practice the attacker submits variants to the product, observes whether each is blocked, and adjusts the features they control until one passes. No access to the model weights or training data is required.

Q: Why are machine learning detectors easier to evade than rules?

Rules fail completely when a pattern is missed, but models fail along a surface. They generalise from training data into regions of feature space nobody has examined, and an attacker who can move an input into such a region gets a confident wrong answer. Three properties make this worse for security: the attacker controls most of the input, the deployed product acts as a free black-box oracle that returns verdicts, and any second model built to detect adversarial inputs has the same kind of boundary. The best documented case is the 2019 Skylight Cyber research against a leading AI-based endpoint product. The researchers found that the model heavily weighted certain strings and that appending a selected set of strings taken from a legitimate game executable to known malware flipped the verdict to benign. It was a universal bypass requiring no knowledge of the model internals. Academic work from 2018 on adversarial malware binaries showed that changing a small fraction of bytes in an executable's padding, chosen by optimising against the model's score, evaded an end-to-end deep malware detector without changing program behaviour.

Q: What is the single most effective defence against evasion of a fraud or abuse model?

Changing the cost asymmetry. The attacker's loop is cheap because each probe costs nothing and each verdict is returned instantly. The highest-leverage defences make a probe expensive and a verdict uninformative: per-identity decline budgets, verdict rate limits, proof-of-work or device attestation, removal of scores and reason codes from responses, delayed or randomised outcomes such as holds and shadow bans, and a probing detector that watches for near-threshold clustering and variant families. None of these improve offline accuracy. All of them slow the attacker's optimisation.

Q: Does adversarial training make a detection model robust?

Partly, and only within a defined scope. Projected gradient descent adversarial training, introduced by Madry and colleagues in 2017, and toolkits such as the Adversarial Robustness Toolbox let you generate evasive variants of your own samples and train on them. This raises the cost of the specific perturbation family and budget you trained against. It does not protect against a different kind of modification, a feature you did not perturb, or an attacker who changes strategy. Treat adversarial training as one layer that raises cost, not as a certificate of robustness for real-world feature spaces.

Q: How does a feedback loop for false positives become a poisoning channel?

If analyst-cleared false positives and customer-disputed declines flow directly into the next training set, an attacker's successful evasions are labelled benign and the retrained model learns to allow them. The same loop that makes a model adaptive makes it poisonable. Defences are provenance-based: quarantine labels that originate from the subject of the decision, require independent confirmation before a label can move a boundary, canary each retrain against a frozen golden set, and keep rollback ready. In a deployed detector, evasion and poisoning are the same attack at two points in time.

Q: What should I ask an EDR, fraud or bot-management vendor about adversarial robustness?

Ask what the product returns to callers and whether scores and reason codes can be disabled. Ask what happens if one tenant submits 10,000 variants of a sample in an hour. Ask which features dominate the model and how many the attacker controls. Ask how customer-reported false positives reach training data and what prevents abuse of that channel. Ask whether they run evasion red-team exercises per release mapped to MITRE ATLAS and will share the method. Ask what deterministic control catches the case when the model is wrong. A vendor who answers everything with continuous learning is describing the poisoning channel.

Q: Should I replace my rules engine with a machine learning detector?

No. Keep the rules as the floor under the model. Confirmed indicators, hard velocity limits, allowlists of known-good signers, sanctions and known-mule lists do not generalise, which is exactly why an attacker who has found a blind spot in the model still has to pass them. If the organisation will not fund a query-cost layer and a deterministic backstop around a model that faces a motivated adversary, a well-maintained rule set with human review is the safer design, because its failures are legible and its blind spots do not move in response to probing.
