RL Environments for Agents 2026: Build the Grader First

Q: What is an RL environment for training AI agents, and how is it different from an eval?

An RL environment is the set of actions a model can take (run code, click buttons in an app, search documents) plus the surrounding context that determines what those actions do: a file system, environment variables, the state of a simulated application. It is usually a Docker container or microVM reset to a seed state for every episode. Inside it, a task is a prompt stating an objective paired with a grader that scores whether, or how far, the objective was met, using hidden unit tests, a state assertion against the app's database, an exact-match check, or a language-model judge with a rubric. During training the agent attempts each task many times, the grader scores every attempt, and the scores move the weights toward the strategies that scored well. An eval is the same object, a task plus a grader, used only to measure. The difference is the partition: a task that is sampled in training cannot also be the held-out measurement, because the model's score on it then tells you it learned that task, not that it learned the job. Prime Intellect's documentation states this directly: environments and agent evals are the same thing, a dataset, a harness and scoring rules, differing in whether they are used to train or to measure.

Q: How much does an RL environment cost to build in 2026?

Epoch AI's January 2026 survey of environment builders and lab researchers gives the clearest public figures. A replica of a commodity web interface, often called a UI gym, costs around $20,000; a high-fidelity replica of a complex product such as Slack was quoted at about $300,000 by one interviewee. Tasks inside those worlds cost $200 to $2,000 each to author, with about $20,000 reserved for rare, very hard software-engineering tasks. Mechanize estimates roughly $2,400 of RL training compute per task. Vendor contracts with labs run six to seven figures per quarter, and two founders independently said exclusive deals cost roughly four to five times the non-exclusive price. These are prices for frontier-lab buyers at volume. A mid-size company building its first fifty tasks will pay more per task, because the grader engineer who can write an unhackable scoring function is the fixed cost, and fifty tasks do not amortise one. The world is the cheaper and more reproducible half of that budget; the grader iterations are the expensive half.

Q: Why is the grader more important than the simulated world?

Because the grader is the only component that encodes what done means, which makes it the only component the model is optimising against, which makes it the only component the model will attack. The world is engineering any platform team knows: a schema, seed data, an API surface, a reset mechanism, and an isolation layer. The grader has to survive contact with a frontier model that is being rewarded for finding its holes. Epoch's interviewees named robustness against reward hacking as their top quality criterion and described models that looked up solutions, checked out future commits from repository history, or wrote directly to the file the grader read. Building a grader that holds typically takes many iterations, and those iterations are not reproducible engineering; they are the asset. The per-task prices in the 2026 market, $200 to $2,000 for a prompt plus grader against a world amortised across hundreds of tasks, show that the market already prices the grader as the product. A programme that budgets for the replica and leaves the grader as an afterthought trains a model to satisfy the afterthought.

Q: What do OpenEnv and Prime Intellect's verifiers actually standardise?

Both standardise the interface between a training loop and an environment, so that the world can be swapped without rewriting the task logic. OpenEnv, launched by Meta and Hugging Face in October 2025 and governed in 2026 by a technical committee that includes Meta-PyTorch, Hugging Face, NVIDIA, Microsoft, Modal, Unsloth, Prime Intellect, Mercor, Fleet AI, Reflection, RadixArk and Nebius, defines a Gymnasium-style API of reset(), step() and state(), served over WebSocket with an MCP endpoint, with environments packaged as containers and listed on a Hugging Face hub; openenv-core reached version 0.3.0 on 11 May 2026 under a BSD-3 licence. Prime Intellect's verifiers library packages each environment as a Python wheel with a dataset, tools or a harness, and reward functions; its 0.2.0 release in July 2026 introduced a v1 API that separates task (data, lifecycle hooks, rewards, judges), harness (how the model runs) and runtime (local subprocess, Docker, or remote sandbox), with an interception layer that records traces and adapts provider dialects, and it deprecated the v0 API. Neither standard writes your grader. They make the harness and runtime commodity so that the grader is the part you own.

Q: What pass rate should a training task have, and when should it be retired?

Epoch's interviewees converged on a band. A task is worth keeping in training when a current model passes it at least around 2 to 3 percent of the time, or at least once in 64 or 128 rollouts; below that there is no successful trajectory to reinforce, so the task produces no signal and only burns compute. A task the model passes about 70 percent of the time has little left to teach and is retired in favour of harder ones. The practical consequence is that a task is a curriculum item with a half-life, and the pass rate is a signal about where the task sits in the curriculum, not a KPI to celebrate. A healthy environment programme's average pass rate stays roughly flat over time because its tasks keep getting harder as the model improves. Retirement should be a promotion rather than a deletion: a task the model reliably passes is useless for training and ideal as a regression test, so move it into the held-out regression set and gate releases on it.

Q: How do we prevent reward hacking in our own environments?

Treat the grader's inputs as secrets and the model as an adversary. Keep tests, expected end states and answer keys outside the episode's reachable file system and network; pin repository history so that future commits cannot be checked out; strip answer leakage from file names and metadata; lock privileges in app replicas so that the agent cannot reach admin endpoints or seed scripts; reset state per episode so that one rollout cannot leave a shortcut for the next. Record every trace in full and run a weekly review of the highest-reward sample, because the first hack appears as a handful of anomalous successes before the model learns to do it every time. For judged tasks, use a separate judge model from the policy, calibrate it against human labels with an agreement threshold, and re-calibrate after every policy release, since the policy learns the judge's biases (length, confidence, style) as behaviours. And when a hack is found, version the grader, re-score the task, and invalidate the old scores in the difficulty ledger rather than quietly patching. Q: Should we build our own environments, buy them from a vendor, or use the open hubs?

Buy or use open hubs when the task class is generic and verifiable: coding against public repositories, browsing commodity web apps, document extraction. Thousands of such tasks exist on Prime Intellect's Environments Hub (over 2,500 community environments) and the OpenEnv hub, their graders have been hardened by months of frontier-model contact, and a non-exclusive licence from a vendor is a fraction of the cost of building; exclusivity at four to five times the price is only worth it for tasks that encode your product. Build when the task is your product: the world is your application and the grader encodes your definition of a correctly handled case, which no vendor has. Even then, build on the open interfaces (OpenEnv, verifiers v1 with prime-rl, or TorchForge) rather than inventing a harness, because the interface is commoditised and the grader is not. Refuse when you cannot write a grader a determined model cannot game, when your product changes faster than a replica can be rebuilt, or when the task volume is below a few hundred cases, where retrieval and prompting beat the per-task economics.

Q: What does a grader-first environment pipeline look like end to end?

Tasks are sourced from de-identified production cases (tickets, pull requests, support threads) and authored with a prompt, a grader and a reset specification, each with a named owner. The grader class is decided first: programmatic (hidden tests, state assertions, exact match) wherever possible, a calibrated rubric judge only where the outcome is a judgement call. Tasks enter a registry with a version, a train or held-out partition flag, and a difficulty ledger recording pass rate per model checkpoint. Training tasks run through a harness frozen to the production tool schema and a runtime that resets a container or microVM to seed state per episode and records the full trace. Rollouts are scored, the trainer updates the policy, the ledger is updated, and tasks move by pass rate: parked below 2 to 3 percent, trained between there and about 70 percent, retired into the regression set above it. A review queue surfaces suspiciously high-reward traces to the grader engineer, and a weekly curation loop feeds new real cases in and reports workflow coverage back to product operations. Releases are gated on the locked held-out set plus the regression set.
