Q: What is continual learning in production machine learning?

Continual learning means a deployed model keeps updating from new production data instead of being trained once and frozen. In practice it ranges from frequent scheduled retrains, through daily warm-start fine-tuning with replay, to true per-event online learning. Whatever the mechanism, each update changes production behaviour, so it should be treated like a software release with versioning, testing and rollback.

Q: What is catastrophic forgetting and why does it happen?

Catastrophic forgetting is when a neural network trained sequentially on new data loses performance on what it learned before, because gradient updates for the new distribution overwrite parameters that encoded the old one. In production it usually shows up as the model quietly forgetting rare but expensive patterns, such as seasonal fraud or peak demand, that are under-represented in recent data.

Q: How do you prevent catastrophic forgetting in a production model?

Combine three controls. Mix a curated replay buffer of older and rare examples into every update, consider regularisation such as elastic weight consolidation or parameter isolation with adapters, and gate each candidate on a frozen memory set of cases the model must not get worse at. The memory set is what actually detects forgetting; the training tricks only reduce it.

Q: Should we use online learning or scheduled retraining?

Start by measuring decay. Run a frozen copy of the model alongside production for several weeks. If its performance stays within tolerance for a month, scheduled retraining is enough. Use daily warm-start updates when decay is visible within a week, and near-online updates only when labels arrive within hours and a single bad prediction is cheap and easily reversed.

Q: What is a memory set in continual learning?

A memory set is a curated, frozen evaluation dataset of cases the model must keep handling well: last year's peak season, known fraud rings, key customer segments and past incidents. Unlike a rolling holdout, it changes only through human review. Every candidate update is compared with the current champion on it, and a regression blocks promotion even when fresh metrics improve.

Q: How do delayed labels affect continual learning?

Many labels mature slowly: chargebacks can arrive 30 to 90 days after a transaction, and returns or churn even later. If you train on recent data before labels mature, every update learns that new events are disproportionately negative or legitimate, which biases the model. Train only on matured labels, or model label delay explicitly, and keep the label window in the version lineage.

Q: Can we roll back a model that learns online?

Only if you planned for it. Per-event updates change weights continuously, so take snapshots on a timer, keep the last known good checkpoint loaded, log the model version on every prediction and monitor online metrics against a champion. Without snapshots and version logging, rollback means retraining from an old data window, which can take longer than the incident lasts.

Q: Does Google's Nested Learning solve catastrophic forgetting for production systems?

Not yet. Nested Learning, introduced by Google Research in November 2025, frames a model as nested optimisation problems updated at different rates, and its proof-of-concept Hope architecture targets forgetting. It is promising research, but it is not a drop-in replacement for production fraud, ranking or forecasting models, and it does not remove the need for gates, canaries and rollback.
